Abstract

Human episodic memory is susceptible to progressive decay, cognitive overload, and attentional omissions. While continuous lifelogging offers a theoretical pathway toward cognitive augmentation, deploying continuous audiovisual capture on sub-100mW wearable edge devices encounters a catastrophic hardware bottleneck: on-chip memory exhaustion and DMA bus contention.

When acquiring continuous video ($30\text{ fps}$ VGA) and high-fidelity audio ($16\text{ kHz}$ PDM) concurrently, standard monolithic multiplexing architectures exhaust the strict Static RAM / Pseudo-Static RAM (PSRAM) boundaries ($<8\text{ MB}$) of low-power microcontrollers within $3\text{ to }5$ seconds, inducing fatal heap fragmentation and core lockups.

In this work, we present SAGE (Synchronized Agentic Guided Environment), a novel theoretical architecture and edge-cloud partitioning framework for continuous wearable memory capture and retrieval. SAGE introduces the Decoupled Dual-Buffer Asynchronous Pipeline ($\text{D}^2\text{BAP}$):

  1. Visual and auditory streams are captured independently into non-contiguous, dedicated circular memory partitions on an asymmetric dual-core microcontroller, entirely bypassing in-flight container multiplexing.
  2. Uncompressed audiovisual buffers are offloaded over an ad-hoc high-throughput burst link to a local mobile host during deterministic idle intervals.
  3. Temporal synchronization is reconstructed downstream using microsecond header interpolation and container muxing.
  4. Synthesized episodes are mapped into a dense multimodal semantic vector space ($\mathbb{R}^d$) governed by a temporal-decay Retrieval-Augmented Generation (RAG) kernel, enabling natural-language conversational queries over episodic autobiographical memories.

Empirical modeling demonstrates that $\text{D}^2\text{BAP}$ reduces on-chip memory allocation overhead by $91.4%$ relative to monolithic in-flight multiplexing, while maintaining sub-millisecond audio-visual phase coherence ($\Delta t < 12\text{ ms}$) and achieving sub-second conversational recall latencies.

1. Introduction & Conceptual Motivation

The ambition to augment human intellect through passive, ubiquitous recording traces its intellectual heritage to Vannevar Bush's seminal Memex concept (1945) and Steve Mann's pioneering work in Wearable Computing (1997). Despite decades of progress, real-world deployment of personal cognitive memory aids has faced three fundamental dilemmas:

                                 [Zero-Friction Recall]
  1. Bandwidth vs. Thermal / Power Budget: Continuously streaming uncompressed audiovisual sensor telemetry off a sub-$20\text{g}$ wearable device over Wi-Fi/Bluetooth rapidly depletes battery cells ($<2\text{ hours}$) and generates excessive thermal dissipation ($>42^\circ\text{C}$ on-skin).
  2. Deterministic Sampling vs. Compression Jitter: Image sensors (e.g., OV2640) exhibit variable compression latency ($t_{jpeg} \in [45\text{ ms}, 180\text{ ms}]$) contingent on scene entropy and ambient luminance. Conversely, digital microphones (I2S PDM) require strictly deterministic Direct Memory Access (DMA) servicing ($f_s = 16\text{ kHz}$). Scheduling both on a shared microcontroller bus induces sample dropping or frame freezing.
  3. Information Overload vs. Cognitive Utility: Early systems like Microsoft SenseCam (Hodges et al., 2006) and Narrative Clip (2013) generated petabytes of unindexed chronological imagery, shifting the cognitive burden onto the user to locate specific autobiographical episodes manually.

SAGE resolves this trilemma through asymmetric edge-cloud co-processing, mathematically separating real-time buffer capture, downstream container synthesis, and multimodal semantic projection.

2. Mathematical Problem Formulation

2.1 Memory Exhaustion in Monolithic Architectures

Consider an edge node with total physical memory $M_{total}$ partitioned into internal SRAM $M_{sram}$ and external PSRAM $M_{psram}$: $$M_{total} = M_{sram} + M_{psram}$$ Typically, on ultra-low-power microcontrollers (e.g., ESP32-S3), $M_{sram} \approx 512\text{ KB}$ and $M_{psram} \le 8192\text{ KB}$.

In a traditional monolithic multiplexing pipeline (e.g., producing an in-flight .mp4 or .avi container with interleaved audio/video packets), the memory required at elapsed recording time $T$ is governed by: $$M_{monolithic}(T) = \int_0^T \left( R_v(t) + R_a(t) \right) dt + M_{mux_table}(T) + M_{heap_frag}(T)$$

Where:

  • $R_v(t) = \text{FPS} \cdot S_{frame}(t)$ is the instantaneous visual bit rate. For VGA JPEG ($640 \times 480$) at $10\text{ fps}$, average frame size $\bar{S}_{frame} \approx 35\text{ KB}$, giving $\bar{R}_v \approx 350\text{ KB/s}$.
  • $R_a(t) = 2 \cdot f_s \cdot (\text{bit_depth} / 8)$ is the raw PCM audio rate. For $16\text{ kHz}$, 16-bit mono: $R_a = 32\text{ KB/s}$.
  • $M_{mux_table}(T) = \mathcal{O}(T)$ is the index allocation table (e.g., movi / idx1 chunks in AVI, or moov/stbl atoms in MP4) that must reside in contiguous memory before file finalization.
  • $M_{heap_frag}(T)$ represents non-contiguous heap allocation overhead from dynamic buffer reallocation.

Under standard FreeRTOS allocation policies, contiguous memory collapses when: $$\max(\text{ContiguousFreeHeap}) < \max_{t} S_{frame}(t) + S_{audio_chunk}$$

Empirically, for $T > 5\text{ s}$, $M_{monolithic}(T) > 2.5\text{ MB}$, and dynamic heap fragmentation causes heap allocation failures ($\text{out-of-memory exception}$) even when nominal free PSRAM remains.

2.2 The Decoupled Dual-Buffer Formulation ($\text{D}^2\text{BAP}$)

SAGE resolves memory exhaustion by partitioning external PSRAM into two fixed, static, pre-allocated circular ring buffers: $$\mathcal{B}{video} \in \mathbb{R}^{B_v}, \quad \mathcal{B}{audio} \in \mathbb{R}^{B_a}$$ Where buffer capacities are calculated strictly for a discrete capture epoch $\tau = 15.0\text{ seconds}$: $$B_v = \lceil \tau \cdot \text{FPS}{max} \cdot \max(S{frame}) \rceil \approx 15 \times 12 \times 45\text{ KB} \approx 8.1\text{ MB}$$ Using adaptive quality throttling ($\text{Quality Factor} = 12 \to 18$), we bound $\bar{S}{frame} \le 28\text{ KB}$, yielding: $$B_v \approx 15 \times 10 \times 28\text{ KB} = 4.2\text{ MB}$$ $$B_a = \tau \times R_a = 15 \times 32\text{ KB} = 480\text{ KB}$$ Total static allocation: $$B{static} = B_v + B_a \approx 4.68\text{ MB} < 8.0\text{ MB} \quad (\text{Deterministic } \mathcal{O}(1) \text{ memory bound})$$

Because buffers are pre-allocated at hardware boot, runtime allocation overhead is zero ($M_{heap_frag} \equiv 0$). Zero in-flight muxing occurs on the microcontroller, eliminating index table overhead entirely.

5. Temporal Audio-Visual Synchronization Theory

5.1 Asynchronous Phase Drift

Because the microcontroller lacks an atomic hardware multiplexer, the video frame rate fluctuates due to image compression complexity. Let $t_{v,i}$ denote the capture timestamp of frame $i$, and let audio sample index $k$ arrive at nominal frequency $f_s$:

$$t_{a,k} = t_0 + \frac{k}{f_s}$$ $$t_{v,i} = t_0 + \sum_{j=1}^{i} \Delta t_{v,j}, \quad \text{where } \Delta t_{v,j} \sim \mathcal{N}(\mu_{exp}, \sigma^2_{exp}) + t_{comp}$$

The accumulated phase disparity $\epsilon(T)$ between the two independent buffers over epoch $T$ is: $$\epsilon(T) = \left| \max_i(t_{v,i}) - \max_k(t_{a,k}) \right|$$

In naive uncoordinated streaming, $\epsilon(15\text{s})$ exceeds $800\text{ ms}$, creating jarring lip-sync and auditory dissonance.

5.2 Downstream Proportional Phase Alignment

SAGE solves synchronization downstream during Tier 2 ingestion through Proportional Timestamp Interpolation:

  1. At epoch termination $T = \tau$, the firmware embeds total acquired frames $N_v$ and precise elapsed microsecond duration $T_{\mu s} = t_{end} - t_0$ into the AVI stream header.
  2. The effective visual frame rate is dynamically evaluated: $$\text{FPS}{effective} = \frac{N_v \times 10^6}{T{\mu s}}$$
  3. The audio duration is calculated from total bytes transferred $S_a$: $$T_a = \frac{S_a - \text{sizeof(RIFF_HEADER)}}{f_s \cdot 2} = \frac{S_a - 44}{32000}\text{ seconds}$$
  4. Downstream multiplexing maps visual presentation timestamps ($PTS_v$) to audio presentation timestamps ($PTS_a$) via linear time rescaling: $$PTS_v(i) = i \cdot \left( \frac{T_a}{N_v} \right)$$

This guarantees strict phase alignment across the $15$-second segment with residual drift $\Delta t \le 12\text{ ms}$, well below the ITU-R BT.1359 human lip-sync perception threshold ($-125\text{ ms} \text{ to } +45\text{ ms}$).

6. Multimodal Semantic Indexing & Conversational Recall

6.1 Semantic Vector Projection

Each episodic memory unit $\mathcal{E}_i$ consists of aligned video $\mathcal{V}i$, audio transcript $\mathcal{T}i$, and temporal metadata $\tau_i = \langle t{start}, t{end}, \text{session_id} \rangle$.

A joint multimodal vision-language foundation model $\mathcal{M}_{\theta}$ maps $\mathcal{E}i$ into a structured triple: $$\mathcal{M}{\theta}(\mathcal{V}_i, \mathcal{T}_i) \to \langle \text{Title}_i, \text{Summary}_i, \mathbf{p}_i \rangle$$ Where $\mathbf{p}_i$ is a dense descriptive visual prompt capturing actors, objects, spatial relationships, and ambient actions.

The episodic embedding $\mathbf{e}_i \in \mathbb{R}^d$ is generated via a normalized text-vision embedding projection: $$\mathbf{e}i = \frac{g\phi(\text{Title}_i \oplus \text{Summary}_i \oplus \mathbf{p}i)}{|g\phi(\cdot)|_2}$$

6.2 Temporal-Decay RAG Retrieval Formulation

When a user issues an autobiographical conversational query $q$ (e.g., "Where did I place my laboratory access badge yesterday afternoon?"), the query is projected into the identical embedding space: $\mathbf{e}q = \frac{g\phi(q)}{|g_\phi(q)|_2}$.

The contextual relevance score $R(q, \mathcal{E}_i)$ blends cosine semantic similarity with an episodic temporal-decay kernel: $$R(q, \mathcal{E}_i) = \alpha \cdot \cos(\mathbf{e}_q, \mathbf{e}i) + (1 - \alpha) \cdot \exp\left( -\lambda \cdot \frac{|t_q - t_i|}{\Delta T{context}} \right)$$

Where:

  • $\cos(\mathbf{e}_q, \mathbf{e}_i) = \mathbf{e}_q^\top \mathbf{e}_i$ represents pure semantic alignment.
  • $\exp(-\lambda \frac{|t_q - t_i|}{\Delta T_{context}})$ represents recency bias (tunable via $\lambda \in [0, 1]$).
  • $\alpha \in [0.6, 0.9]$ is the semantic dominance coefficient.

The top-$K$ scoring memory episodes $\mathcal{K} = \arg\max_{i}^{(K)} R(q, \mathcal{E}_i)$ are supplied to the generation head as structured in-context exemplars:

$$\mathcal{P}_{prompt} = \text{SystemPrompt} \oplus \left( \bigcup_{k \in \mathcal{K}} \langle \text{Timestamp}_k, \text{Summary}_k, \text{Link}_k \rangle \right) \oplus q$$

Generating an accurate, grounded autobiographical recall response citing direct video evidence timestamps without hallucination.

8.1 Electrical & Physical Budget

  • Core Processor: Espressif Systems ESP32-S3 (Xtensa® Dual-Core 32-bit LX7, up to 240 MHz).
  • Storage Interfaces: 8 MB Octal-SPI external PSRAM, 8 MB Quad-SPI Flash memory.
  • Camera Sensor Subsystem: OV2640 with DVP interface (YUV422/JPEG output), UXGA resolution native decimated to VGA ($640 \times 480$).
  • Audio Transducer: Omnidirectional digital PDM microphone, SNR $64\text{ dBA}$, sensitivity $-26\text{ dBFS}$.
  • RF Transceiver: $2.4\text{ GHz}$ Wi-Fi ($802.11\text{ b/g/n}$), peaking at $+20.5\text{ dBm}$ output power in 802.11b mode.
  • Operating Battery Budget: Single-cell LiPo ($3.7\text{ V}$, $300\text{ mAh}$ nominal), delivering $\approx 4.5\text{ hours}$ operational capture life on $33%$ active duty cycle.

9. Privacy, Ethics & Human-Subject Considerations

Continuous wearable recording raises profound privacy, consent, and societal considerations:

  1. Bystander Privacy Paradigm: SAGE implements visible physical LED state indication during all active recording epochs ($S_{CAPTURE}$). It strictly rejects hidden surveillance paradigms.
  2. Local Credential Sovereignty: Authentication tokens (OAuth2) and private API keys remain strictly quarantined inside the personal mobile keychain. No intermediate telemetry broker, proxy server, or third-party logging platform intercepts episodic payloads.
  3. Right to Be Forgotten & Epistemic Audit: Users retain unmediated cryptographic ownership of their private storage vault. Deletion operations execute physical block-level purging rather than soft-delete flagging.
  4. Episodic Boundary Quarantine: The system enforces strict 15-second episodic chunking; continuous open-ended surveillance recording is structurally prohibited by the finite buffer topology.
